Hands-On RAG Retrieval: Index Local Documents with Qdrant

This lab builds the retrieval portion of a document-based AI assistant: read a small directory of text files, split them into token-bounded passages, create real local embeddings, query Qdrant and assemble a source-labeled prompt. An optional generation step is explained separately so retrieval success is not mistaken for a verified AI answer.

Tested October 14, 2026: Python 3.12.14, FastEmbed 0.9.0, ONNX Runtime 1.31.0 and Qdrant 1.19.2. The embedding computation ran locally on CPU with synthetic documents. No customer data or paid model API was used. We did not execute an LLM generation step or benchmark an InterServer VPS.

1. Prepare an isolated lab

Start the private Qdrant instance from the vector database lab. It publishes only 127.0.0.1:16333. Do not open an unauthenticated database port to the Internet.

The following environment commands are for a Linux shell with Python 3.12 and its venv support installed. Use a new project directory and a normal user account, not a root-owned directory of real customer notes.

python3 -m venv .venv
. .venv/bin/activate
python -m pip install fastembed==0.9.0 tokenizers==0.23.3

The lab uses FastEmbed with BAAI/bge-small-en-v1.5. The initial run downloads public model and tokenizer files; embedding the documents then runs locally. Account for download access and model storage. Review any other services or logging you add before making broader privacy claims.

2. Create a tiny corpus you can inspect

Create a new lab-notes directory with three UTF-8 text files. These are invented test documents, not actual InterServer project records.

  • api.txt: Project Cedar chose REST for its public API because the team already knows REST conventions.
  • gardening.txt: Tomato plants need regular watering and adequate sunlight.
  • backup.txt: Database backups run nightly and are restored in a separate test environment.

This corpus has an obvious relevant source for the question about Cedar’s API. Establish that simple case before importing a large collection where a plausible result may conceal an indexing error.

3. Index and retrieve with a single script

Put this in rag.py. It reads only top-level .txt files, skips symlinks, limits file and corpus size, and starts a new uniquely named collection on each run. It does not delete or overwrite an existing collection.

        print(point["payload"]["source"], round(point["score"], 4))
    print(output["prompt"])
python rag.py ./lab-notes "Which API style did the Cedar team choose?"

In the recorded local test, api.txt ranked first with a score of approximately 0.7393. That number describes this model and synthetic query; it is not a general acceptance threshold. The output includes retrieved sources and a prompt, not a generated answer.

4. Check chunking and refresh behavior

The model uses a 512-token input limit. This example takes windows of up to 384 tokens with overlap, preserves source text through token offsets, and rejects any reconstructed passage exceeding the limit. A word count such as 500 words does not safely substitute for an embedding model’s token limit.

The tests also used a longer synthetic document to verify bounded chunks. They changed the API decision to GraphQL and re-ran retrieval in a new collection, then removed the API document and confirmed that the next run did not retrieve its old chunks.

Each run queries only its new collection. Previous collections remain stored: this is a deliberately small, manual lab, not a nightly synchronization service. Do not schedule it as-is. A production index needs versioned ingestion, a safe switch to the new index, explicit cleanup, deletion propagation and rollback. Back up first and never recreate a production collection just to make a tutorial rerun succeed.

5. Add generation as a separate integration

After checking the retrieved passages, an application can send the assembled prompt to a generation model. For example, an already configured local Ollama service accepts a model name and prompt through its generate API; non-streaming requests use stream: false. Choose an installed model, apply a timeout, and size its context window and output budget for the retrieved text.

This integration was not executed in our test, so this article does not include a purported real model answer or promise that a particular model fits a small VPS. Measure the complete stack’s memory and latency, not merely the model download size.

Ask the model to cite source labels and decline when the excerpts do not answer the question, then test whether it actually does so. A prompt instruction is not a guarantee. Retrieved documents can contain prompt-injection attempts; keep tool permissions separate from document content.

Before using real documents

This single-user lab has no authentication layer or per-document authorization. Add authenticated access and enforce document permissions before retrieval, not merely after the model has received private text. Use explicit metadata for tenant and project identifiers; a Qdrant equality filter on a path is not a recursive directory match.

Test known-answer and no-answer questions, stale documents, conflicting sources, failed embedding jobs and restore procedures. Keep source files as the authoritative records and define how updates and deletions reach the index. For per-user memory operations, see the owned memory-store lab.

Document retrieval is separate from hosting-account automation. For the latter, see the InterServer MCP Server guide.
